Machine learning is fun! Part 4: Face Recognition with Deep Learning | By Pavel Pleskov

Have you noticed that Facebook suddenly has a super ability to recognize your friends in a photo? In the old days, Facebook allowed you to tag your friends in a photo, but to do so, you had to click on the photo and enter the friend's name. Now, as soon as you upload a photo, Facebook will magically put all the necessary tags:

This technology is called face recognition. Once you tag your friends in a photo a few times, Facebook will learn to recognize their faces. It's pretty amazing technology - Facebook can recognize faces with an accuracy of 98% - almost as accurate as a human!

Let's see how modern facial recognition technologies work! But the simple recognition of the faces of friends will not be limited here - it's too simple. We can bring this technology to perfection and solve a more difficult problem - to distinguish Will Ferrell (famous actor) from Chad Smith (famous rock musician)!

In Parts 1, 2, and 3, we used machine learning to solve isolated problems in one step—estimate the value of a house, create new data from existing data, or determine if an object is in an image. To solve these problems, it is enough to choose some kind of machine learning algorithm, enter the data, and here it is the result.

However, face recognition consists of many interrelated subtasks:

  1. First, you need to look at the picture and find all the faces in it
  2. Second, you need to learn to recognize each face, even if it is strangely rotated, or if the lighting bad - it's still the same person.
  3. Thirdly, you need to be able to identify unique facial features that distinguish one person from others, such as eye size, face shape, and so on.
  4. Finally, you need to compare the identified unique features of this face with all the people that the system already knows in order to understand who is in the photo.

The human brain does everything instantly and imperceptibly for us. It can be said that humans are so good at recognizing faces that they see faces even in everyday objects: step.

We need to build a kind of pipeline where we execute each recognition step separately, and then pass the result of the current step to the next one. In other words, we will sequentially connect several machine learning algorithms:

Let's deal with the task in order, or rather, step by step. At each stage, we will deal with the machine learning algorithm (it will be different for each stage). I will not explain each algorithm in full so that the article does not turn into a book. Instead, I'll lay out the basic ideas behind each one, and you'll also learn how to build your own facial recognition system in Python using OpenFace and dlib.

The first step in our pipeline is to detect faces . Clearly, we need to find the faces in the photo before doing anything else.

If you've used any camera in the last 10 years, you've probably seen face recognition in action:

Face recognition is a great feature for cameras. If the camera can automatically highlight faces, it can make sure all faces are in focus before taking a picture. But we will use this algorithm for a different purpose - we need to select areas in the image, which we will pass to the next step of our pipeline.

Face detection became mainstream in the early 2000s when Paul Viola and Michael Jones invented a way to detect faces that was fast enough to work on cheap cameras. However, today there are more reliable solutions. We're going to use a method invented in 2005 - the Histogram of Oriented Gradients - or simply HOG , for short.

To find faces in an image, we first make our image black and white, because no color data is needed to find faces:

We then look at each pixel in our image, one by one. But we are not so much interested in the pixel itself, but in the pixels surrounding it:

Our goal is to find out how dark the current pixel is compared to its neighbors. Then we draw an arrow showing in which direction the image gets darker:

By doing this procedure for each individual image pixel, you will replace each pixel with an arrow. These arrows are called with gradients, and they show the direction from light to dark pixels throughout the image:

This method may seem random, but there is actually a good reason to replace pixels with gradients. If we analyze the pixels directly, we can see that dark images and light images of the same person will have completely different pixel brightness values. But, considering only the direction of the change in brightness, we get the same picture regardless of the brightness of the original image. This greatly simplifies the task!

However, storing the gradient for each pixel is too much information, and we might not see the forest for the trees. It would be better if we could see the main direction of light change at a higher level, thus getting the overall outline of the image.

To do this, we will divide the image into small squares of 16x16 pixels each. In each square, we will count how many gradient points are rotated in each of the main directions (up, up, right, right, etc.). Then we will replace this square in the image with arrows pointing in the same direction as most.

We end up transforming the original image so that the basic structure of the face is clearly visible:

To find a face in a HOG image, all we have to do is find the part of our image that most closely resembles the known HOG drawing, obtained from many other faces during training:

Using this method, we can easily find faces in any image:

So, the faces were found. But now we have to deal with the problem when the faces turned in different directions seem to the computer as different faces:

To solve the problem, we will try to transform each image so that the eyes and lips are always in a particular place. This will make it easier to compare faces in the next steps.

For this we will use an algorithm called face landmark estimation (face landmark estimation) . There are many ways to do this, but we will use a method invented in 2014 by Vahid Kazemi and Josephine Sullivan.

The basic idea is that we will mark 68 feature points (called landmarks ) that exist on each face - the top of the chin, the outer point of each eye, the inner point of each eyebrow, etc. Then we will train the machine learning to find these 68 special points on any face:

Here is the result of placing 68 landmarks on our test image:

Now that we know where the eyes are and where the mouth is, we can rotate, scale, and shift the image so that the eyes and mouth are as centered as possible. In this case, we will not make any fantastic three-dimensional distortions, as this spoils the image. We will only use basic image transformations such as rotation and scaling that preserve parallel lines (affine transformations):0041

Now, no matter how the face is rotated, we can center the eyes and mouth at roughly the same position in the image. This will make the next step more accurate.

If you want to try to do it yourself using Python and dlib, here are links to code to find facial landmarks and code to transform an image using those landmarks.

Now we come to the heart of the problem - how to distinguish one person from another. And this is where things get really interesting!

The simplest approach to face recognition is to directly compare the unknown face we found in step 2 with all the images of people that have already been tagged. If we find a previously tagged face that is very similar to a recognizable face, then it's probably the same person - isn't it a brilliant idea?

Not really. This approach has a big problem. A site like Facebook, which has billions of users and trillions of photos, cannot compare all previously tagged faces with every new image uploaded - it would take too long, while faces should be recognized in milliseconds, not hours.

So we need a way to take some basic measurements from each face that we can compare with the closest known measurements and find the most similar face. For example, we can measure the size of each ear, the distance between the eyes, the length of the nose, etc. If you've ever watched crime TV shows like CSI, you know what I'm talking about:

So what face measurements do we need to replenish the known database? Ear size? Nose length? Eye color? Something other?

It turns out that measurements that seem obvious to humans (like eye color) don't really make sense to a computer looking at individual pixels in an image. Researchers have shown that the most accurate approach is to let the computer itself measure what it needs. Deep learning determines which parts of the face to measure better than humans.

The solution is to create a deep learning convolutional neural network (as in part 3). But instead of teaching the network to recognize objects in the image, as we did last time, we will teach it to create 128 measurements for each face.

During network training, three faces are analyzed at the same time:

  1. A training image of a famous person's face
  2. Another photo of the same famous person
  3. An image of a completely different person

The algorithm then looks at the measurements it makes for each of these three images . It then tweaks the neural network a bit to make sure the measurements generated for images #1 and #2 are more similar, and the measurements for #2 and #3 are less similar:

By repeating this step millions of times for millions of images of thousands of different people, the neural network learns to reliably generate 128 measurements for each person. Any ten different images of the same person should give roughly the same measurements.

The resulting 128 measurements of each face are called map . The idea of ​​converting an array of raw data, such as an image, into a list of computer-generated numbers is extremely important for machine learning (especially for automated translation). The face approach we use was invented in 2015 by Google researchers, but there are many similar approaches as well.

This process of training a convolutional neural network to obtain a face map requires a lot of data and a powerful computer. Even with an expensive NVidia Telsa graphics card, it takes 24 hours of continuous learning to get good accuracy.

But once the network is trained, it can generate measurements for any face, even one that it sees for the first time! Therefore, it only needs to be done once. Lucky for us, the guys at OpenFace have already done this and published some trained networks that we can use. Thanks, Brandon Amos ( Brandon Amos ) and his team!

Thus, we only have to pass the face images through the finished trained network to get 128 measurements for each face. Below are the measurements for our test image:

And what parts of the face correspond to these 128 numbers? And we have no idea. But for us it doesn't matter much. We are only interested in the fact that the network generates almost the same numbers from two images of the same person.

If you'd like to try this step yourself, OpenFace provides a lua script that generates maps of all images in a folder and writes them to a csv file. Here's how to run it.

The last step turns out to be the easiest in the whole process. All we have to do is find the person in our database of famous people whose measurements are closest to ours.

You can do this using any basic machine learning classification algorithm. And you don't need any fancy stuff. We will use a simple linear SVM classifier ( support vector machine ), but other classification algorithms will work.

All we need to do is train a classifier that will take measurements from the image we are checking and tell us which person we know most resembles him. Running the classifier takes milliseconds, and the output is the name of a person!

So let's try out our system. I first trained the classifier using about 20 photos by Will Ferrell, Chad Smith and Jimmy Fallon ( Jimmy Fallon ):

Then I ran the classifier on every frame of the famous YouTube video of Will Ferrell and Chad Smith pretending to be each other on Jimmy Fallon:

It worked! Notice how well this works even in different facial positions - even sideways!

Let's repeat the procedure:

  1. Encoding the image using the HOG algorithm to create a simplified version of the image. Using this simplified image, find the part of the image that most closely resembles the original HOG encoding of the face.
  2. Determine the position of the face by marking the main landmarks on it. Once you find these guidelines, use them to transform the image and center the eyes and mouth.
  3. Run a centered face image through a neural network that can measure facial features. Save these 128 measurements.
  4. By comparing the measurements with those we received in the past, find the most similar person - this is our client!

UPDATE 9/4/2017: You can follow these steps with OpenFace. However, I have released a new Python face recognition library called face_recognition which is much easier to install and use. Therefore, I recommend that you first try face_recognition, and only then move on!

What's more, I've built a pre-configured virtual machine with face_recognition, OpenCV, TensorFlow, and many other deep learning tools pre-installed. You can easily download and run this machine on your computer. Give it a try if you don't want to install all those libraries yourself!

We are already accustomed to studying at home, we take online courses for improving skills as a given, and Instagram bloggers who launch another marathon of earwax candles cause only a tired smile.

When big budgets came to online education, it ceased to seem like a lot of hacks and geeks. Moreover, along with the new market, proudly identifying itself as IT, new professions have emerged. One of them was the profession of Methodist , around which a train of "new rap" quickly appeared.

The emergence of all kinds of retraining courses was only a matter of time. Methodist has become one of the courses of popular online universities along with full stack, testing and graphic design.

Does such a program have the right to exist? The laws of the market unequivocally say "yes" if someone is willing to pay for such a product. However, does this program correspond to what the methodologist will have to do in practice? This question is more difficult to answer.

Is an edtech methodologist like a product?

More recently, aunts who were members of school methodological associations were called Methodists. Sometimes these they came to the lessons of young teachers and endowed them with their wisdom. And sometimes they didn't commit themselves to anything.

Today this understanding has changed somewhat:

Methodist (in English literature - instructional designer, ID) is a person who designs and develops educational materials and events. He asks the question: "How best to organize the learning process and the material in order to convey it to the student?"

Pupils can be completely different people:

  • kids in preparation for school;

  • teenagers in circles after school;

  • college and university students;

  • professionals who want to improve their career;

  • representatives of "dying professions";

  • pensioners within the framework of social projects.

Depending on the input, the specifics of the work can be very different, so now in Russian edtech there is no common understanding of the duties of a methodologist. More precisely, everyone interprets them in their own way.

Let's take a look at the challenges I faced at two edtech companies. The first one was engaged in additional education of schoolchildren (let's call it Detstvo LLC), and the second one was engaged in professional retraining of adults (Karera LLC).

Methodist at LLC "Childhood" - a sage:

  1. Receives an order to develop the course "Programming in Python".

  2. Independently develops the course program, starting from the global goal, ending with the detailing of educational results at the lesson stage level.

  3. Independently develops all the lessons of the course. Each lesson includes many tasks for the children to solve and materials for the teacher.

  4. Self-uploads materials to the learning platform. Sets up auto-check with test cases for each task. There are about 25 tasks in each lesson.

  5. Maintains lesson cards in Jira, where he guides tasks through the stages: development, review by the lead methodologist, editing, QA, publication, issuance of materials for translation.

  6. Supports the developed educational product. Communicates both with other departments and with direct users: teachers and students.

It turns out that the methodologist at Detstvo LLC is a real multi-machine operator. It independently closes most tasks without the involvement of various experts. This is possible if the methodologist has a good understanding of the subject (for example, experience in teaching computer science at school) and knowledge of age characteristics.

Methodist at Career LLC - custodian:

  1. Receives an order to develop the course "FS Developer in Python".

  2. Together with a recognized expert from the industry, formulates the purpose of training and highlights its components. Each component is refined in a whirlwind of "stupid" questions from the methodologist and "wise" expert advice.

  3. Together with the experts (also called “authors”), the facilitator develops all modules of the course. A module is one week of training.

  4. Each module is born in the dance of the author and the methodologist. Why was this metaphor chosen? Because you never know in advance what kind of dance you will dance - a classic waltz, a crazy tango or a sensual solo.

  5. In the dance, the methodologist throws out teaching methods with proven effectiveness, and the author throws out frameworks and practices from the industry. At the same time, the methodologist is immersed in the full stack, and the author learns educational technologies.

  6. As a result of the dance, a document is born outlining the entire module. It is sent to the technician to be uploaded to the LMS.

  7. After the content is studied by students, the evaluation of the educational product is carried out. Metrics can be different, for example, NPC.

In such companies, the methodologist cannot complete the course alone, because he does not have deep knowledge of any profession other than his own. Experts help him in this, and it is important to strike a balance here. If the expert pulls the blanket over himself, then the course will be unbearable for beginners. If a methodologist, then interesting and easy, but not helping to find a profession.

These are far from the only interpretations of the teaching profession. Whether the retraining program presented above helps you get a job in these companies is up to you.

Modern edtech is very heterogeneous. It has everything from online math problems to trendy lifestyle lectures. Depending on the segment, the role of the methodologist in course development also changes. Along with this, there are several universal theses:
